مدل‌سازی مکانی و پهنه‌بندی خطر فرونشست زمین در استان چهارمحال‌ و بختیاری با استفاده از الگوریتم SOM و تحلیل عملکرد مدل در شناسایی دشت‌های بحرانی

چکیده

مقدمه و هدف
فرونشست زمین به عنوان یکی از مخاطرات خاموش محیطی، تهدیدی جدی برای زیرساخت‌ها، منابع آب و خاک، و امنیت غذایی به‌شمار می‌رود که وقوع آن در مناطق خشک و نیمه‌خشک به دلیل برداشت بی‌رویه از منابع آب زیرزمینی تشدید می‌شود. استان چهارمحال و بختیاری با موقعیت راهبردی خود به عنوان بام ایران و سرچشمه رودخانه‌های کارون و زاینده‌رود، نقش حیاتی در تأمین آب و غذای کشور ایفا می‌کند؛ با این حال در سال‌های اخیر، ظهور شکاف‌های متعدد در دشت‌های مهمی مانند شهرکرد، بروجن، فرادنبه و سامان، زنگ خطر جدی را برای این منطقه به صدا درآورده است. علی‌رغم وجود گزارش‌های پراکنده از وقوع فرونشست، فقدان یک پژوهش جامع و سیستماتیک که با بهره‌گیری از فناوری‌های نوین به بررسی ابعاد این بحران بپردازد، کاملاً مشهود است. از این رو، پژوهش حاضر با هدف پهنه‌بندی مکانی خطر فرونشست زمین در استان چهارمحال و بختیاری با استفاده از قابلیت‌های مدل یادگیری ماشین SOM (Self-Organizing Map) و تصاویر ماهواره‌ای انجام شده است تا ضمن شناسایی مناطق بحرانی و عوامل مؤثر بر وقوع این پدیده، نقشه‌های دقیق و کاربردی برای مدیریت ریسک و اتخاذ تدابیر پیشگیرانه در اختیار برنامه‌ریزان و مدیران اجرایی قرار دهد.
مواد و روش‌ها
مدل: SOM این مدل یک نوع شبکه عصبی مصنوعی با یادگیری بدون نظارت است که داده‌های پیچیده با ابعاد بالا را گرفته و به یک نقشه دو بعدی تبدیل می‌کند. در این نقشه، داده‌های مشابه در کنار یکدیگر قرار می‌گیرند و امکان کشف الگوهای پنهان را فراهم می‌آورند. داده‌ها: برای مدل‌سازی، ۳۰ متغیر اولیه مؤثر بر فرونشست در نظر گرفته شد. پس از بررسی ماتریس همبستگی و حذف متغیرهای با همبستگی بالا (بیشتر از ۰.۷)، در نهایت ۲۳ متغیر نهایی برای اجرای مدل انتخاب شدند. این متغیرها شامل مواردی مانند ارتفاع، شیب، جهت شیب، فاصله از گسل، فاصله از رودخانه، فاصله از جاده، زمین‌شناسی، کاربری اراضی، شاخص‌های توپوگرافی (مانند TWI، TRI، TPI)، داده‌های اقلیمی (دما، بارش) و پوشش گیاهی بودند. داده‌های نقاط دارای فرونشست نیز با استفاده از داده‌های GPS سازمان صمت و بازدیدهای میدانی تهیه شدند. آموزش و ارزیابی مدل: داده‌ها به دو گروه آموزشی و آزمون تقسیم شدند. مدل با ۲۳۵۲ نقطه آموزشی (شامل ۱۸۵۹ نقطه با فرونشست و ۴۹۳ نقطه بدون فرونشست) آموزش دید و با ۷۷۲ نقطه آزمون (شامل ۵۳۶ نقطه با فرونشست و ۲۳۶ نقطه بدون فرونشست) ارزیابی شد. برای سنجش عملکرد مدل از شاخص‌های سطح زیر منحنی (AUC)، دقت (Precision) و یادآوری (Recall) استفاده شد.
نتایج و بحث
عملکرد مدل: ارزیابی مدل SOM نشان‌دهنده عملکرد مناسب آن بود. مقدار AUC برابر با 76/0 به‌دست آمد که حاکی از توانایی خوب مدل در تشخیص مناطق حساس به فرونشست است. شاخص Precision معادل 7/0 (قابل قبول) و شاخص Recall معادل 99/0 (بسیار بالا) محاسبه شد که نشان می‌دهد مدل به‌خوبی توانسته نقاط دارای فرونشست را به‌درستی شناسایی کند. پهنه‌بندی خطر: بر اساس خروجی مدل، نقشه پهنه‌بندی خطر فرونشست در پنج کلاس (خیلی کم، کم، متوسط، زیاد و خیلی زیاد) تهیه شد. بر اساس این نقشه، حدود ۳۴ درصد از سطح استان در کلاس خطر کم، ۲۶ درصد در کلاس متوسط، ۳ درصد در کلاس زیاد و ۳۷ درصد در کلاس خطر خیلی زیاد قرار دارد. به عبارت دیگر، مجموعاً ۴۰ درصد از استان در طبقات خطر زیاد و خیلی زیاد واقع شده است. مناطق بحرانی: بر اساس نقشه نهایی، دشت‌های شهرکرد، بروجن، بن و سامان به‌عنوان بحرانی‌ترین مناطق با بالاترین درجه خطر فرونشست شناسایی شدند. بخش‌هایی از دشت‌های لردگان و اردل نیز در زمره مناطق با خطر بسیار زیاد قرار دارند. در مقابل، دشت کوهرنگ در معرض خطر کم و خیلی کم ارزیابی شده است.مقایسه با پژوهش‌های دیگر: دقت مدل SOM در این پژوهش (AUC=0.76) با نتایج مطالعه‌ای در دشت تبریز با مدل رگرسیون (AUC=0.8) و مطالعه‌ای در دشت سلماس با منطق فازی (AUC=0.8) قابل مقایسه بوده و عملکرد آن را تأیید می‌کند.
نتیجه‌گیری و پیشنهادها
پژوهش حاضر کارایی مدل یادگیری ماشین SOM را در پهنه‌بندی خطر فرونشست زمین در استان چهارمحال و بختیاری تأیید می‌کند. یافته‌ها وضعیتی هشداردهنده را نشان می‌دهند، به‌طوری که بیش از یک ‌سوم مساحت استان (۳۷ درصد) در معرض خطر بسیار بالای فرونشست قرار دارد و دشت‌های شهرکرد، بروجن، بن و سامان به عنوان بحرانی‌ترین مناطق شناسایی شده‌اند. نوآوری این مطالعه در استفاده همزمان از داده‌های میدانی و مدل‌سازی با هوش مصنوعی برای ارائه تصویری روشن و علمی از این بحران است. نتایج این پژوهش می‌تواند به‌عنوان ابزاری مؤثر در اختیار مدیران و برنامه‌ریزان برای اتخاذ تدابیر پیشگیرانه و مدیریت پایدار منابع آب و خاک در استان قرار گیرد. بر این اساس، پیشنهاد می‌شود که اقدامات مدیریتی به صورت فوری در دشت‌های بحرانی متمرکز شده و ضمن کنترل شدید برداشت از آبخوان‌ها و اجرای طرح‌های تعادل‌بخشی، پایش مستمر نرخ فرونشست با فناوری پیشرفته تداخل‌سنجی راداری در دستور کار قرار گیرد. همچنین، انجام پژوهش‌های تکمیلی با بهره‌گیری از مدل‌های پیشرفته‌تر یادگیری ماشین، داده‌های دقیق‌تر مکانی و زمانی (مانند سری‌های زمانی تصاویر راداری و داده‌های پیزومتری) و بررسی کمی اثر عوامل انسانی و سناریوهای تغییر اقلیم بر تشدید فرونشست، برای دستیابی به دقت بالاتر و درک عمیق‌تر از این پدیده توصیه می‌شود.

Introduction and Goal
Land subsidence, as one of the silent environmental hazards, poses a serious threat to infrastructure, water and soil resources, and food security, and its occurrence is exacerbated in arid and semi-arid regions due to the over-extraction of groundwater resources. Chaharmahal and Bakhtiari Province, with its strategic location as the roof of Iran and the source of the Karun and Zayandeh-Rud rivers, plays a vital role in supplying the country's water and food. However, in recent years, the emergence of numerous fissures in important plains such as Shahrekord, Borujen, Faradonbeh, and Saman has sounded a serious alarm for this region. Despite scattered reports of subsidence occurrence, the lack of a comprehensive and systematic study that investigates the dimensions of this crisis using modern technologies is quite evident. Therefore, the present study was conducted with the aim of spatial zoning of land subsidence hazard in Chaharmahal and Bakhtiari Province using the capabilities of the Self-Organizing Map (SOM) machine learning model and satellite imagery. This research seeks to identify critical areas and the factors influencing this phenomenon, ultimately providing accurate and practical maps for risk management and the adoption of preventive measures by planners and executive managers.
Materials and Methods
SOM Model: SOM is an artificial neural network that uses unsupervised learning. It takes complex, high-dimensional data and projects it onto a two-dimensional map, placing similar data points close together and enabling the discovery of hidden patterns. Data: For modeling, 30 primary variables affecting subsidence were initially considered. After analyzing the correlation matrix and removing variables with high correlation (greater than 0.7), 23 final variables were selected for model implementation. These variables included elevation, slope, aspect, distance to fault, distance to river, distance to road, geology, land use, topographic indices (such as TWI, TRI, TPI), climatic data (temperature, precipitation), and vegetation. Data on subsidence points were collected using GPS data from the Sanat Maadan va Tejarat organization and field surveys around irrigation canals, power poles, and concrete structures. Model Training and Evaluation: The data were randomly divided into training and testing sets. The model was trained with 2,352 points (including 1,859 subsidence points and 493 non-subsidence points) and evaluated with 772 points (including 536 subsidence points and 236 non-subsidence points). Model performance was assessed using the Area Under the Curve (AUC), Precision, and Recall indices.
Results and Discussion
Model Performance: The evaluation of the SOM model demonstrated its good capability. The AUC value was 0.7685, indicating the model's suitable ability to distinguish areas susceptible to subsidence. The Precision index was calculated as 0.70 (acceptable), and the Recall index was very high at 0.99, showing that the model successfully identified the subsidence points. Hazard Zonation: Based on the model's output, a subsidence hazard zonation map was produced with five classes (Very Low, Low, Moderate, High, and Very High). According to this map, approximately 34% of the province's area falls into the Low hazard class, 26% into Moderate, 3% into High, and 37% into the Very High hazard class. In total, 40% of the province is located in high and very high hazard zones. Critical Areas: Based on the final map, the Shahrekord, Borujen, Ben, and Saman plains were identified as the most critical areas with the highest degree of subsidence risk. Parts of the Lordegan and Ardal plains are also classified as areas with very high risk. In contrast, the Kuhrang plain is assessed to be at low and very low risk. Comparison with Other Studies: The accuracy of the SOM model in this study (AUC=0.76) is comparable to the results of a study in the Tabriz plain using a regression model (AUC=0.8) and a study in the Salmas plain using fuzzy logic (AUC=0.8), confirming its performance.
Conclusion and Suggestions
The present study confirms the effectiveness of the Self-Organizing Map (SOM) machine learning model in zonation of land subsidence hazard in Chaharmahal and Bakhtiari Province. The findings reveal an alarming situation, with more than one-third of the province's area (37 percent) exposed to a very high risk of subsidence, and the plains of Shahrekord, Boroujen, Ben, and Saman identified as the most critical zones. The innovation of this study lies in the simultaneous use of field data and artificial intelligence modeling to provide a clear and scientific picture of this crisis. The results of this research can serve as an effective tool for managers and planners to adopt preventive measures and ensure sustainable management of water and soil resources in the province. Accordingly, it is recommended that management actions be urgently concentrated in the critical plains, implementing strict control over aquifer extraction and executing aquifer rehabilitation projects, while continuous monitoring of subsidence rates using advanced radar interferometry technology is pursued. Furthermore, conducting additional research using more advanced machine learning models, more precise spatial and temporal data (such as time series of radar images and piezometric data), and a quantitative investigation of the impacts of human factors and climate change scenarios on the intensification of subsidence is recommended to achieve higher accuracy and a deeper understanding of this phenomenon.
